LoREnc: Low-Rank Encryption for Securing Foundation Models and LoRA Adapters

TL;DR
LoREnc is a training-free framework for cryptographic-style protection of foundation models and LoRA adapters. The threat model is intellectual property leakage and model recovery attacks against on-device generative AI. Existing defenses are impractical because they require retraining or access to the original dataset. LoREnc applies three operations: spectral truncation suppresses dominant low-rank components of the foundation model weights, compensation restores the missing information in authorized adapters, and orthogonal reparameterization obscures structural fingerprints of the protected adapter. Unauthorized users produce structurally collapsed outputs; authorized users recover exact performance. Computational overhead is under 1%.
Key findings
- The spectral-truncation-plus-compensation idea inverts the usual low-rank compression trick: low-rank components are the protected payload, and the foundation model is published as a degraded version.
- The 1% overhead is the relevant deployment number. Standard encryption schemes for model weights add multiples of the inference cost. LoREnc adds noise.
- Training-free is the deployment-friendly property. The defense bolts onto an existing model and adapter pair.
- Orthogonal reparameterization is the line of defense against structure-based fingerprinting attacks, which is the missing piece in spectral-only protections.
Why this matters
Edge-deployment foundation models are now common (Apple's on-device Llama 3, Qwen2.5-3B in mobile assistants, Phi-4 in laptop AI). The IP problem is real and unresolved: shipping the weights to the device leaks the weights. LoREnc is the first scheme that survives both naive copy and the more aggressive model-recovery attacks that try to fit a surrogate by querying the deployed model.
The trade-off is worth naming. The published "encrypted" foundation model is a worse model than the original. An adversary who is happy with the degraded version has nothing to attack; the defense aligns incentives by making the public artifact useful only with the adapter. Whether this game-theoretic alignment holds when the degradation is small is the open empirical question.
