DVAO: Dynamic Variance-adaptive Advantage Optimization for Multi-reward RL

TL;DR

GRPO (Group Relative Policy Optimization, the value-free PPO substitute popular for LLM RL) is unstable when multiple reward signals are combined. Standard recipes are Reward Combination (weight-sum then advantage) or Advantage Combination (per-reward advantage then weight-sum); both fail. Reward Combination blows up the squared advantage magnitude and destabilizes training; Advantage Combination relies on hand-tuned static weights and ignores cross-objective correlations. DVAO replaces the static weights with per-objective dynamic weighting based on empirical reward variance inside each rollout group: up-weight objectives with strong learning signal (high variance), down-weight objectives that are already saturated or noise-dominated (low variance). The paper proves DVAO maintains bounded advantage magnitudes and adds a self-adaptive cross-objective regularizer. Tested on Qwen3 and Qwen2.5 on math reasoning and tool-use benchmarks, DVAO beats Reward Combination and Advantage Combination on the Pareto frontier.

What it does

  • Rollout group: N completions sampled from the current policy on the same prompt.
  • For each objective i, compute the empirical variance of the reward r_i across the rollout group.
  • Set the combination weight w_i(t) proportional to that variance (with normalization). Objectives with concentrated signal (high variance) get up-weighted.
  • Compute per-objective advantage A_i in the GRPO style.
  • Combined advantage A = sum w_i(t) A_i.
  • A self-adaptive regularizer penalizes cross-objective conflict, preventing the dominant-variance objective from steamrolling the others.

The mathematical contribution is a bound on the magnitude of the combined advantage. Reward Combination has no such bound; DVAO's combined advantage stays inside a provable envelope.

How this relates to prior wiki pages

This is the multi-objective generalization of the selectivity thread that ran through 2026-05-25 (HINT-SD picking failure-relevant action spans, Good Token Hunting picking attention-relevant tokens, Pion picking spectral filter shape by regime). All four reduce to the same statement: uniform application of a fixed policy across heterogeneous structure is the failure mode; the right move is per-unit adaptation. DVAO does it at the reward-objective axis where prior work did it at the token, action, and singular-value axes. The Reward Combination instability DVAO diagnoses is the same noise-amplification failure mode the Shannon Scaling Law (2026-05-25) formalized at the model-design scale and Pion at the optimizer-step scale.

This is also the natural composition with the rubric-augmented reward modeling thread (C2 from 2026-04-18 and the Themis multilingual reward models from 2026-05-04): once reward modeling produces a multi-rubric vector reward, the downstream RL needs DVAO to actually train on it without collapsing.

Research angle

The natural next paper is dynamic weights that are policy-conditioned, not just rollout-group-conditioned: w_i(state) lets the optimization weight different rewards differently for different prompts, which is what you actually want for a multi-skill agent (math prompts care about correctness reward; tool-use prompts care about plan reward). The current DVAO is one step from that. Whether it generalizes cleanly to LLM-as-judge rewards (which have lower variance because the judge is itself stochastic) is the second open question.

Industrial implication

Anyone running multi-reward GRPO post-training (which is now the default at every frontier lab for combining correctness, helpfulness, safety, and format compliance) inherits DVAO's training-stability story immediately. The Pareto frontier improvement is the kind of result that shows up in next-generation post-training stacks within a quarter.
