Speculative Pipeline Decoding (SPD): Zero-Bubble Speculation via Pipeline Parallelism

TL;DR

Speculative decoding (SD) speeds up low-concurrency LLM inference with a draft-then-verify loop, but mainstream methods lean on multi-token prediction, which gets harder the further ahead you predict and adds serial drafting latency. SPD partitions the target model into n pipeline stages so the model processes n tokens in parallel, and a speculation module aggregates intermediate features across pipeline depths to predict the next token, running strictly in parallel with the target's pipeline step. The result is bounded prediction difficulty, higher acceptance rates, and zero latency bubbles (no idle pipeline stages).

Diagram

Multi-token-prediction SD: draft k tokens ahead serially ─► difficulty grows with depth, serial latency
pipeline has BUBBLES (idle stages) in single-sequence decode

SPD: split target into n pipeline stages ─► n tokens in flight at once
speculation module aggregates intermediate features ACROSS pipeline depths
runs in PARALLEL with the target's pipeline step
─► bounded difficulty · higher acceptance · ZERO bubbles

Key points

  • Reframes speculation around pipeline parallelism. Instead of a separate draft model predicting many tokens ahead (escalating difficulty), SPD fills the pipeline by predicting one token per stage from aggregated intermediate features, so each prediction is short-range and easier.
  • Zero-bubble. The speculation module executes strictly in parallel with the target model's pipeline step, so no stage sits idle during single-sequence decoding — the classic inefficiency of pipeline-parallel decode.
  • Bounded difficulty + higher acceptance. Aggregating features across pipeline depths gives a more accurate next-token guess than deep multi-token prediction.
  • Claimed significantly higher theoretical speedup than mainstream SD baselines; code released at github.com/yuyijiong/speculative_pipeline_decoding.

Relation to prior wiki knowledge

SPD and today's Draft-OPD attack speculative decoding from opposite ends. Draft-OPD (2026-06-02, on-policy distillation for the draft model, 5x lossless) improves the quality of the drafter so more proposed tokens get accepted. SPD changes the system structure so drafting incurs no serial latency and no pipeline bubbles. Together they mark a maturing of the field: the easy wins from a better draft architecture (EAGLE3, DFlash) are giving way to better training objectives (Draft-OPD) and better hardware scheduling (SPD). See speculative-decoding.md.

The "spend compute where it is cheap and parallel, not serially" instinct in SPD rhymes with the wiki's broader efficiency thread of locating and exploiting the parallelizable, load-bearing part of the computation rather than treating decode as a uniform serial loop.
